Transfer Learning

Adapting a pre-trained model for a new, but related, task to reduce the need for extensive new data.
Definition

Transfer Learning is a machine learning method where a model developed for one task is repurposed as the starting point for a model on a second, related task. This approach leverages the knowledge a model has gained from its initial training (often on a large, comprehensive dataset) and applies it to a different but related problem, requiring significantly less data for the new task.

Transfer learning is particularly valuable when labeled data for the new task is scarce or when training a model from scratch is computationally expensive. It's commonly used in deep learning, where models pre-trained on large datasets like ImageNet are adapted for tasks with fewer labeled data. The process often involves fine-tuning, where the pre-trained model's parameters are slightly adjusted to better suit the new task, allowing for rapid development and deployment of models across a wide range of applications.

Examples/Use Cases:

In image classification, a model pre-trained on a general dataset such as ImageNet can be fine-tuned to classify specific types of images, like medical scans or satellite imagery, by retraining the model's last few layers on a smaller, task-specific dataset.

In natural language processing, models like BERT, initially trained on vast amounts of text data, can be adapted for specific tasks such as sentiment analysis or question-answering by fine-tuning the model on a smaller, domain-specific corpus.

In autonomous driving, transfer learning can be used to adapt models trained on driving data from one city or set of conditions to perform well in a new geographic location or under different driving conditions, by fine-tuning the model with local driving data. These examples highlight how transfer learning facilitates the application of AI across diverse domains, leveraging existing knowledge to reduce the time, data, and resources needed for model development.
